Pillar 01 · System Topology

Zero-Trust AI Gateway & Core Topology

In enterprise production, foundation models must never be exposed directly to client applications. Every transaction passes through an intermediary AI Gateway providing deterministic validation, PII redaction, semantic caching, and dynamic token rate-limiting before payload dispatch.

Pillar 02 · Execution Flow

The 10-Step Enterprise Request Lifecycle

Unlike a prototype that sends unverified strings directly to an LLM endpoint, a production AI request undergoes ten deterministic verification and safety stages.

01Stage

Ingress & Identity

The enterprise gateway validates mTLS, OIDC JWT tokens, and RBAC roles before any computational resources are allocated.

02Stage

Classification & Risk

Lightweight classifiers determine query intent, safety score, data residency constraints, and target workflow path.

03Stage

DLP & PII Redaction

Inbound prompts pass through regex filters and entity extraction to mask SSNs, API tokens, and confidential customer data.

04Stage

Semantic Caching

Vector embedding caches (Redis/pgvector) check for identical or semantically duplicate queries to bypass inference costs entirely.

05Stage

Permissioned Context Retrieval

Hybrid search queries the vector store, applying row-level security (RLS) filters to return only authorized knowledge chunks.

06Stage

Model Routing & Prompt Assembly

The orchestrator constructs structured prompts and routes the payload to the lowest-cost model capable of handling the task.

07Stage

Deterministic Validation

Generated outputs pass strict JSON schema enforcement (Zod/Pydantic), hallucination checks, and banned-phrase scanning.

08Stage

Human-in-the-Loop Confirmation

State-altering operations (database writes, financial payments, external emails) halt execution pending human authorization.

09Stage

Audited Execution

Approved actions execute against enterprise APIs with least-privilege credentials, returning structured results to the user.

10Stage

Telemetry & Eval Logging

Complete trace logs, latency benchmarks, token expenditures, and user feedback stream to observability platforms (OpenTelemetry).

Pillar 03 · Structural Foundation

The 8 Layers of Enterprise AI Architecture

Enterprise systems fail when organizations treat the foundation model as the entire architecture. Stable implementations separate concerns across eight distinct tiers.

1. Experience & Channel Layer

Ingress

Unified access across browser applications, mobile interfaces, Slack/Teams bots, and internal developer APIs.

Design Principle: The presentation layer must remain stateless and never possess direct database credentials or bypass gateway policies.

2. Identity & Access Management (IAM)

Security

Granular verification connecting enterprise identity providers (Okta, Azure AD, Ping) directly to AI authorization scopes.

Design Principle: Permissions must be enforced deterministically by infrastructure, never delegated to model prompt instructions.

3. Gateway & Policy Firewall

Control

Centralized policy enforcement handling rate limiting, prompt injection defense, PII masking, and tenant token quotas.

Design Principle: Decouple prompt protection and policy enforcement from individual application services.

4. Orchestration & Workflow Engine

Routing

Deterministic state machines coordinating context retrieval, multi-turn memory, tool execution, and dynamic model routing.

Design Principle: Prefer deterministic code-driven workflows over unconstrained autonomous reasoning wherever tasks follow repeated business patterns.

5. Context & Knowledge Subsystem

Memory

Hybrid dense-sparse vector databases, operational data warehouses, and knowledge graphs grounded with metadata filters.

Design Principle: Knowledge stores must enforce tenant isolation and ACL filtering directly at the database engine query level.

6. Model Infrastructure Layer

Compute

Hybrid model fleet spanning self-hosted specialized models (vLLM, TensorRT-LLM) and managed cloud foundation APIs.

Design Principle: Route tasks to the smallest and fastest model that reliably satisfies accuracy and governance constraints.

7. Tool & Enterprise Integration Layer

Execution

Secured connectors to ERP, CRM, databases, and ticketing software executing via OpenAPI schemas and least-privilege scopes.

Design Principle: Tools must validate arguments with strict schemas and enforce non-repudiation audit trails for all state changes.

8. Observability & Continuous Governance

Telemetry

Distributed tracing, continuous automated regression testing, cost allocation per department, and safety monitoring.

Design Principle: A platform without automated evaluation and tracing cannot maintain production compliance or predictable operating costs.

Pillar 04 · Context Engineering

Production RAG: Hybrid Search & Access Control

Standard vector similarity search breaks on technical documentation, product IDs, and tabular reports. Production platforms deploy a two-stage retrieval pipeline combined with mandatory database-level access control lists (ACLs).

1. Hybrid Retrieval (Dense + Sparse)Stage 1

Combine BM25 keyword search for exact term matching (SKUs, error codes, legal clauses) with dense embedding vectors for semantic intent. Reciprocal Rank Fusion (RRF) merges candidate lists before reranking.

RRF_Score = (RRF_Dense * 0.6) + (BM25_Sparse * 0.4)

2. Cross-Encoder RerankingStage 2

Vector indexes return candidate chunks quickly, but lack positional relevance. Feed the top 25 chunks into a cross-encoder model to evaluate joint query-document relevance, truncating to the top 4–6 high-density chunks.

Top 25 Candidates ──► Cross-Encoder ──► Top 5 Chunks

Security Mandate: Pre-Filtering at the Database Engine

Never perform post-retrieval filtering for user permissions. If an employee does not have read access to a document, that chunk must be excluded directly within the vector database query using tenant metadata tags (e.g., filter: { allowed_groups: ["engineering-staff"] }).

Pillar 05 · Model Economics

Task-Based Model Routing Strategy

Running all workloads through premium frontier foundation models results in unsustainable inference bills and excessive latency. Production systems route dynamically based on task complexity.

Workload TypeModel ClassTarget LatencyCost Ratio
Classification, Sentiment & Simple Routing
Narrow deterministic extraction requires minimal parameter reasoning and benefits heavily from local hosting.
Small Local / Edge Model (7B–8B, quantized)< 250 ms1x
Document Q&A, Summarization & RAG
Balances nuanced context comprehension with acceptable token streaming latency for interactive users.
Mid-Tier Production Model (70B or Flash APIs)800 ms – 2.5s5x
Multi-Step Architectural Reasoning & Code Synthesis
Complex multi-variable workflows justify premium pricing and asynchronous processing queues.
Frontier Reasoning Model (Claude Opus / GPT-4 / o1)5s – 45s25x – 60x
Repetitive Structured Data Transformation
Never use probabilistic model inferences where regular expressions or standard code solve the task.
Deterministic Python Worker (Zero LLM)< 50 ms0x

Pillar 06 · Execution Architecture

Deterministic Automation vs Autonomous Agents

The single biggest architectural failure in 2026 enterprise projects is using open-ended autonomous agents for predictable business workflows. Match system autonomy to business uncertainty.

Deterministic AI Automation

Recommended Default

Fixed execution graphs written in standard software (Python, TypeScript). The model is used solely for extraction, classification, or synthesis at specific nodes.

  • ✓ Predictable state transitions and zero infinite execution loops
  • ✓ 100% testable with standard unit and integration testing pipelines
  • ✓ Latency and infrastructure token budgets are mathematically bounded

Autonomous AI Agents

High-Variance Only

Dynamic ReAct or Plan-and-Solve architectures where the model selects which tools to call, inspects intermediate outputs, and decides its next operation dynamically.

  • • Requires hard loop execution bounds and strict maximum token ceilings
  • • Mandatory human approval webhooks before state-mutating API calls
  • • Best suited for deep research, incident triage, and ambiguous discovery

Pillar 07 · Operational SLAs

Enterprise Latency SLAs & Token Budgets

Enterprise workloads must be segmented by response-time expectations. Small models optimize costs for high-throughput tasks, while reasoning models require asynchronous job orchestration.

Workload TierModel ClassTarget Latency (P95)Execution Pattern
Tier 1: Copilot / Fast Chat7B–14B Quantized / Flash APIs< 800 ms (TTFT < 250ms)Streaming with semantic caching
Tier 2: Enterprise RAG70B Parameter / Mid-tier< 3.5 secondsParallel vector retrieval + LLM synthesis
Tier 3: Multi-Agent LoopsFrontier Reasoning Models15 – 90 secondsAsynchronous queues with webhook/SSE

Pillar 08 · Governance

Deterministic Guardrails & Audit Loops

Models may propose actions, but deterministic software policies must authorize them. Enterprise architectures isolate tool execution behind human-in-the-loop gates for financial, data-deletion, or external messaging operations.

Schema Validation

Enforce strict JSON schemas (Zod/Pydantic) on model outputs before hitting internal business systems.

Audit Logging

Record prompt versions, retrieved chunk hashes, and tool parameters in immutable audit sinks.

Human Confirmation

High-impact tool invocations trigger asynchronous approval webhooks before state mutations occur.

Pre-Flight Audit
